Özet
Günümüzde internetin yaygınlaşması ve erişilebilen pazar çeşitliliğinin artmasının meydana getirdiği yoğun rekabet ortamında işletmelerin mevcudiyetlerini koruyabilmeleri ve karlılık düzeylerini arttırabilmeleri için çeşitli stratejiler geliştirmeleri gerekmektedir. Doğru stratejilerin geliştirilebilmesi ve bu stratejiler doğrultusunda kullanılan kaynakların optimizasyonu için işetmelerin müşteri davranışlarını doğru analiz etmesi gerekmektedir. Bu noktada benzer eğilimlere sahip müşterilerin gruplandırıldığı kümeler ile çalışmak kolay ve anlamlı bir süreç yürütülmesini sağlar. Bu amaçla benzer alışveriş alışkanlıklarına sahip müşterilerin bir arada olduğu homojen gruplar oluşturma işlemi müşteri segmentasyonu olarak adlandırılır. Literatürde uygulama ve anlaşılma kolaylığı nedeniyle en çok tercih edilen segmentasyon yöntemi RFM (Recency, Frequency ve Monetary) analizidir. RFM analizi 'R' güncellik metriği ile müşterin son alışveriş tarihini, 'F' sıklık metriği ile referans aralıktaki alışveriş sıklığını ve 'M' parasal değer metriği ile referans aralıktaki total harcamasını analiz eder. Bu üç özellik bakımından benzerlik taşıyan müşterileri bir araya getirerek çeşitli segmentlere ayırır. RFM analizi müşteri segmentasyonu için çok önemli özellikler kullanıyor olsa da çeşitli işletmeler için müşterilerin başka özellikleri de önemli olabilmektedir. Literatürde bu ihtiyaçlardan yola çıkılarak RFM analizine yeni bir metriğin dahil edildiği pek çok çalışma gerçekleştirilmiştir. Bu çalışmada tekrarlı üretimin çeşitli sektörlerde sağlamış olduğu avantajlar göz önünde bulundurularak RFM analizine tekrarlayan sipariş durumunu ifade eden R kodlu 'Repetitive' metriği dahil edilmiş ve RFM-R analizi geliştirilmiştir. Geliştirilen yöntemden elde edilen çıktılarla üretim veriminin arttırılması, ürünlerin müşterilere teslim sürelerinin kısaltılması, varyant yapısından kaynaklanan değişikliklerin getirdiği dezavantajların yönetilmesi amaçlanmıştır. Segmentasyon işlemi için makine öğrenmesi yöntemlerinden denetimsiz öğrenme yöntemleri arasında yer alan K-Means, HDBSCAN ve GMM kümeleme algoritmaları kullanılmış, her bir metot ve her bir algoritma için elde edilen kümelerin performansları küme değerlendirme metrikleri kullanılarak ölçümlenmiş ve kıyaslanmıştır. Geliştirilen yöntem altın takı sektöründe uygulanmış ve bulguların gerçek hayattaki geçerliliği vurgulanmıştır. Elde edilen sonuçlar doğrultusunda oluşturulan segmentler için pazarlama stratejileri önerilmiştir. RFM temelli müşteri puanlaması ve denetimsiz makine öğrenme algoritmaları ile gerçekleştirilen segmentasyonu işlemleri sonucunda müşteriler çeşitli segmentlere ayrıldıktan ve bu segmentler için çeşitli stratejiler önerildikten sonra çalışmanın ikinci kısmına geçilmiştir. İşletmeler için sadık ve kayıp gibi en üst ve en alt segmentlerde olan müşterileri bilmek kadar önemli olan bir diğer konu ise“Potansiyel Müşteriler”olarak nitelendirilen müşterilerin kimler olduğunu bilmektir. Mevcut durumda en iyiler ile bir arada gruplanacak kadar değerli olmayan ancak sadık müşteri olabilme potansiyeli taşıdığını gösteren davranışlara sahip bu müşteriler farklı segmentler içerisinde olabilmekle birlikte bu müşterilerin kim olduğu bilgisi işletme için son derece değerlidir. Güncellik skoru yüksek olan bu müşterilerin Sıklık ve Parasal değer skorları bakımından da umut vadettiklerini ve çeşitli teşviklerle iyileştirilebilecek bir noktada olduklarını söylemek mümkündür. Bu müşteriler için 'Potansiyel Müşteri' olma kriterlerini sağlama durumları hem bireysel bazda hem de içinde bulundukları segmentler bazında önce manuel bir RFM puanlaması ve devamında K-Means, HDBSCAN ve GMM algoritmaları ile oluşturulan kümeler bazında olacak biçimde kontrol edilmiştir. Bu bağlamda önce RFM bazlı puanlama yöntemiyle potansiyel müşteriler elde edilmiştir. Devamında segmentasyon adımlarındakine benzer biçimde K-Means, HDBSCAN ve GMM algoritmalarının oluşturduğu potansiyel müşteri segmentlerinde bulunan müşteriler listelenmiştir. Segment bazlı listelerde ve bireysel bazlı RFM puanlaması listesinde varlığını istikrarlı biçimde koruyan müşterilerin iki yönlü doğrulanmış yüksek potansiyelli müşteriler olduğuna karar verilmiştir.

In today's highly competitive environment, created by the proliferation of the internet and the increasing diversity of accessible markets, businesses must develop various strategies to maintain their presence and increase their profitability. To develop the right strategies and optimize the resources used in line with these strategies, businesses must accurately analyze customer behavior. In this regard, working with clusters that group customers with similar tendencies provides a streamlined and meaningful process. Creating homogeneous groups of customers with similar shopping habits is called customer segmentation. RFM (Recency, Frequency ve Monetary) analysis is the most preferred segmentation method in the literature due to its ease of application and understanding. RFM analysis analyzes the customer's last purchase date using the 'R' recency metric, the 'F' frequency metric for shopping frequency within the reference range, and the total spend within the reference range using the 'M' monetary metric. It groups customers with similarities across these three characteristics and divides them into various segments. While RFM analysis utilizes crucial features for customer segmentation, other customer characteristics may also be important for various businesses. Numerous studies in the literature have focused on these needs and incorporated a new metric into RFM analysis. In this study, considering the advantages of repetitive production in various sectors, the R-coded Repetitive metric, which represents repetitive order status, was incorporated into RFM analysis, and RFM-R analysis was developed. The outputs obtained from the developed method were aimed at increasing production efficiency, reducing product delivery times to customers, and managing the disadvantages of variations arising from variant structure. The developed method was applied to the gold jewelry industry, highlighting the real-world relevance of the findings. For the segmentation process, K-Means, HDBSCAN, and GMM (Gaussian Mixture Model) clustering algorithms, which are among the unsupervised learning methods of machine learning, were used. The performance of the resulting clusters for each method and algorithm was measured and compared using cluster evaluation metrics. Based on the results provided by the cluster performance evaluation metrics, the Silhouette Scores of the clusters obtained for the proposed RFM-R method were lower than those obtained with the classical method, while the Davies-Bouldin Scores were higher. This situation was interpreted as an effect of increasing dimensionality and overlapping behavioral patterns, rather than an outcome of the model's inadequacy. However, in the end, clusters generated with the RFM-R analysis were utilized. The highest cluster performance was obtained for the clustering process performed by the HDBSCAN algorithm. Therefore for interpreting customer behavior and providing targeted strategies based on segments for the business the HDBSCAN clustering algorithm was chosen. Labels 'High Churn-Risk Customers', 'Re-engaging Customers', 'At Risk Repeat Customers', and 'Loyal and Repeat Customers' were assigned to the four resulting segments. The 'High Churn-Risk Customers' segment comprises 35.67% of the total customer data, the 'At Risk Repeat Customers' segment comprises 6%, the 'Re-engaging Customers' segment comprises 9%, and the 'Loyal and Repeat Customers' segment comprises 48.24%. Customer behavior has been analyzed in detail, and various marketing strategies have been proposed for the segments created based on the obtained results to increase value for each segment. After the segmentation processes performed with RFM-R based customer scoring and unsupervised machine learning algorithms resulted in customers being divided into various segments and various strategies being proposed for these segments, the second part of the study was conducted. For businesses, knowing customers in the top and bottom segments, such as loyal and churn customers, is as important as knowing who the customers categorized as“Potential Customers”are. These customers, who are not currently valuable enough to be grouped with the best customers but who, despite being new, demonstrate the potential to become loyal customers, may be found in different segments, and knowing who these customers are is extremely valuable for the business. It can be said that these customers, who have a high relevance score, are also promising in terms of Frequency and Monetary Value scores and are at a point where they can be improved with various incentives. For these customers, their eligibility for being a 'Potential Customer' was checked both individually and within their segments, first through a manual RFM scoring system and then through clusters created using K-Means, HDBSCAN, and GMM algorithms.In this context, potential customers were first obtained using the RFM-based scoring method. Subsequently, similar to the segmentation steps, customers in the potential customer segments created by the K-Means, HDBSCAN, and GMM algorithms were listed. It was determined that customers who consistently maintained their presence in the segment-based lists and the individual-based RFM scoring list are two-way verified high-potential customers. According to the results obtained, it was observed that the customers in the“Potential Customers”cluster obtained with GMM did not match with the potential customers in the clusters determined by K-Means and HDBSCAN, except for 2 customers. Since the cluster performance evaluation metrics did not show high clustering performance for the current dataset, the GMM potential customer cluster was not included in the evaluation. Finally, customers that were commonly found in the customer clusters evaluated as potential by the K-Means and HDBSCAN algorithms were marked as the highest potential customer candidates. In this context, 36 segment-based potential customers and 56 individual-based potential customers were found. High-potential customers appearing as potential customers at both levels were obtained through double validation, and 34 customers were determined to be“Potential Customers”. The Customer ID Numbers, Recency, Frequency, and Monetary Value information of the obtained customers, along with their corresponding R, F, and M scores, are shared.
