Özet
Fındık (Corylus avellana L.), yüksek besin ve ekonomik değeriyle Türkiye için stratejik öneme sahip bir tarım ürünüdür. Bu nedenle, fındık alanlarının doğru şekilde belirlenmesi hassas tarım uygulamaları açısından önem taşımaktadır. Bu tez çalışmasında, Sakarya ilindeki fındık alanlarının mekansal dağılımının belirlenmesi amacıyla farklı çözünürlükteki uzaktan algılama verileriyle, açıklanabilir makine öğrenmesi ve derin öğrenme yaklaşımlarını değerlendiren bütüncül bir yaklaşım benimsenmiştir. Çalışma kapsamında, ilk olarak çok zamanlı Sentinel-2 uydu görüntülerinden üretilen bitki indeksleri kullanılarak fındık bitkisinin fenolojik özellikleri incelenmiştir. Bu amaçla farklı ilçelerde seçilen örnek bahçeler üzerinden NDVI, SAVI ve EVI bitki indekslerine ait zaman serileri oluşturulmuş; tozlanma, çiçek dökümleri, yaprak açımı, döllenme, çotanak gelişimi, hasat ve yaprak dökümü gibi fenolojik dönemler değerlendirilmiştir. Analizler sonucunda, indeks değerlerinin Nisan ayında yaprak açımı ile yükselmeye başladığı, Mayıs–Haziran aylarında döllenme ve çotanak gelişimi süreçleriyle birlikte maksimum değerlere ulaştığı, hasat ve yaprak dökümü dönemlerinde ise belirgin düşüşler gösterdiği belirlenmiştir. NDVI, SAVI ve EVI indeksleri genel olarak benzer fenolojik eğilimler üretmiş, ancak farklı bahçe yapılarında spektral imza davranışlarının değişebildiği belirlenmiştir. Ayrıca, don gibi ekstrem hava olayları kapsamında indeks değerlerinde yaklaşık %5–10 arasında düşüşler gözlemlenmiştir. Fenolojik analizlerden elde edilen bilgiler doğrultusunda, farklı fenolojik dönemleri temsil eden altı farklı Sentinel-2 görüntüsü birleştirilerek 72 bantlı yığın görüntü oluşturulmuş; CORINE arazi örtüsü/arazi kullanımı sınıflarına ek olarak“Fındık”sınıfı tanımlanarak Sakarya ili ölçeğinde veri setleri ve örneklemler oluşturulmuştur. Çalışmada, 60 m mekansal çözünürlüğe sahip Aerosol ve Water Vapor bantlarının sınıflandırma sürecine dahil edildiği ve edilmediği durumlar birlikte değerlendirilmiş; AÖAK sınıflandırmaları için artırma ve torbalama tabanlı makine öğrenmesi sınıflandırıcıları olan XGBoost, LightGBM, CatBoost, Random Forest ve Extra Trees modelleri performans metrikleri ve görsel analizler ile karşılaştırılmıştır. Elde edilen sonuçlar, artırma tabanlı modellerin genel olarak torbalama tabanlı modellere göre daha başarılı sonuçlar ürettiğini göstermiştir. Özellikle XGBoost modeli ile 72 bantlı veri setinde test veri kümesinde bütün sınıflar için %95,43 ve fındık sınıfı için %97,64 F1-Skor elde edilirken, 60 m çözünürlüklü bantların çıkarıldığı durumda bütün sınıflar için %94,88 ve fındık sınıfı için %97,90 F1-Skor elde edilmiştir. Bu durum, atmosferik etkilerden etkilenen bantların genel sınıflandırma performansına katkı sağlayabilmesine rağmen, hedef sınıf olan fındık açısından daha seçici bant kombinasyonlarının daha başarılı sonuçlar üretebildiğini göstermektedir. Hata matrisleri incelendiğinde, spektral olarak benzer özellik gösteren sınıflar arasında karışıklıkların oluşabildiği, buna karşılık fındık ve orman sınıflarının genel olarak yüksek doğrulukla sınıflandırıldığı belirlenmiştir. Alan bazlı değerlendirmelerde XGBoost ve LightGBM modelleri benzer sonuçlar üretirken, Random Forest modelinde bazı sınıflarda daha belirgin alan farklılıkları gözlemlenmiştir. Görsel değerlendirmelerde modeller ve bant kombinasyonları arasındaki farklılıkların çoğunlukla piksel düzeyinde ortaya çıktığı ve özellikle sınıf sınırlarında belirginleştiği görülmüştür. Ayrıca, 60 m çözünürlüklü bantların özellikle su ile ilişkili sınıfların ayrımında ek katkılar sağlayabildiği belirlenmiştir. Modellerin karar mekanizmaları SHAP yöntemi kullanılarak hem spektral bant hem de fenolojik dönem düzeyinde incelenmiştir. Analizler sonucunda, model kararlarında etkili olan spektral bantların ve fenolojik dönemlerin kullanılan modele, hedef sınıfa ve veri seti içeriğine bağlı olarak değişebildiği belirlenmiştir. 60 m çözünürlüklü Aerosol ve Water Vapor bantlarının bazı modellerde açık ara en yüksek katkıyı sağladığı, bu bantların çıkarılmasıyla birlikte özellikle Red Edge ve SWIR bantlarının daha belirgin hale geldiği görülmüştür. Fenolojik dönem analizlerinde yaprak açımı öncesini temsil eden dönemlerde Red Edge bantlarının öne çıktığı, döllenme döneminde ise diğer dönemlerde daha sınırlı öneme sahip olan Red bandının Haziran ayına karşılık gelen döllenme döneminde belirgin şekilde yüksek katkı değerleri ürettiği belirlenmiştir. SWIR bantlarının ise yaprak açımı ve sonrasında daha etkili olduğu görülmüştür. Yerel SHAP analizlerinde, poligon içerisindeki tüm piksellerin tamamen doğru veya tamamen yanlış tahmin edildiği örnekler kullanılarak model davranışları incelenmiştir. Analizler sonucunda yoğun ve homojen taç yapısına sahip bahçelerde modellerin daha başarılı sonuçlar ürettiği, genç ve seyrek bahçeler ile kalıcı tarım alanları sınıfı arasında daha fazla karışıklık oluşabildiği belirlenmiştir. Ayrıca, doğru ve yanlış sınıflandırılan örneklerde öne çıkan bantların sınıfa bağlı olarak farklılaşabildiği gözlemlenmiştir. Çalışmada, hem bütün sınıflar hem de fındık sınıfı özelinde gerçekleştirilen SHAP analizlerinden elde edilen bulgular doğrultusunda farklı bant kombinasyonları oluşturularak XGBoost modeli yeniden eğitilmiştir. Gerçekleştirilen deneyler sonucunda, yaprak açımı öncesi dönemlerde düşük sınıflandırma performansı elde edildiği; buna karşılık diğer dönemlerde ve belirlenen bant kombinasyonlarında daha az sayıda özellik kullanılarak da yüksek performans değerlerine ulaşılabildiği belirlenmiştir. Özellikle bütün sınıflar dikkate alınarak gerçekleştirilen SHAP analizlerinden elde edilen bant kombinasyonlarının, fındık sınıfı özelinde de en yüksek performans değerlerini üretmesi dikkat çekici bir bulgu olarak öne çıkmıştır. Farklı bant kombinasyonları deneyleri sonucunda fındık sınıfı için %97,22, bütün sınıflar için ise %94,55 F1-Skor değerleri elde edilmiştir. Derin öğrenme tabanlı segmentasyon çalışması, fındık alanlarının yoğun olarak bulunduğu yaklaşık 110 km² büyüklüğündeki pilot bölgede çok yüksek mekânsal çözünürlüklü Pléiades Neo görüntüleri kullanılarak gerçekleştirilmiştir. GEOBIA yöntemleri ile üretilen yer gerçeği verileri kullanılarak oluşturulan VHRHazelSeg veri seti üzerinde, SE-ResNeXt50 omurgası kullanan U-Net++, DeepLabv3+ ve SegFormer segmentasyon mimarileri değerlendirilmiştir. Gerçekleştirilen deneyler sonucunda tüm modellerin yüksek başarımlar elde ettiği, en yüksek performansın ise U-Net++ modeli ile test veri setinde %90,98 IoU ve %94,97 F1-Skor değerleriyle sağlandığı belirlenmiştir. Hata matrisi sonuçları göz önünde bulundurulduğunda, spektral olarak benzer ve aynı zamanda veri setinde az temsil edilen sınıflar arasında karışıklıklar devam etse de, parsel düzeyinde daha ayrıntılı sınıf ayrımlarının gerçekleştirilebildiği görülmüştür. Bu bulgular, Sentinel-2 verileri ile gerçekleştirilen il ölçeğindeki sınıflandırma yaklaşımları ile çok yüksek mekânsal çözünürlüklü görüntüler üzerinden gerçekleştirilen derin öğrenme tabanlı segmentasyon çalışmalarının birbirini tamamlayıcı nitelikte olduğunu göstermektedir. Hazelnut (Corylus avellana L.) is an agricultural crop of strategic importance for Türkiye due to its high nutritional and economic value. Therefore, the accurate identification of hazelnut cultivation areas is essential for precision agriculture applications. Sakarya Province was selected as the study area because it has become one of the prominent hazelnut production centers in Türkiye in terms of both production volume and productivity, distinguished by its relatively young orchards and terrain characteristics that are more suitable for mechanized agricultural practices. In this thesis, a holistic framework integrating explainable machine learning and deep learning approaches with remote sensing data of different spatial resolutions was developed to determine the spatial distribution of hazelnut areas in Sakarya Province. In the first stage of the study, the phenological characteristics of hazelnut vegetation were investigated using vegetation indices derived from multi-temporal Sentinel-2 satellite imagery. For this purpose, NDVI, SAVI, and EVI time series were generated for selected orchards located in the major hazelnut-producing districts of Akyazı, Hendek, Karasu, and Kocaali, and phenological stages including flower drop, leaf emergence, fertilization, harvesting, and leaf fall were evaluated using satellite observations acquired throughout 2024. The analyses revealed that vegetation index values began to increase during leaf emergence in April, reached their maximum levels during fertilization and cluster development in May–June, and decreased significantly during harvesting and leaf fall periods. Although NDVI, SAVI, and EVI exhibited similar phenological trends overall, spectral signature responses were found to vary depending on orchard characteristics. Furthermore, analyses conducted following the severe frost events that occurred in 2025 indicated decreases of approximately 5–10% in vegetation index values, demonstrating the sensitivity of these indices to extreme weather conditions. Based on the findings obtained from the phenological analyses, six Sentinel-2 images representing different phenological periods were combined. Using the Google Earth Engine platform, all spectral bands except the Cirrus band (B10) were resampled to 10 m spatial resolution using the nearest-neighbor method to generate a 72-band stacked dataset. In addition to the CORINE LC classes, a separate“Hazelnut”class was defined, resulting in a dataset consisting of 11 LULC classes. A total of 6,687 polygon-based samples were collected and used for training, validation, and testing. The inclusion and exclusion of the 60 m spatial resolution Aerosol and Water Vapor bands were evaluated, and boosting- and bagging-based machine learning classifiers, including XGBoost, LightGBM, CatBoost, Random Forest, and Extra Trees, were compared using both quantitative performance metrics and visual analyses. The results demonstrated that boosting-based models generally outperformed bagging-based approaches. Although boosting-based approaches generally yielded superior results, the performance differences among the evaluated models and band combinations remained limited. Even the lowest-performing results, obtained by the Random Forest model, achieved F1-Scores of 94.33% for all classes and 96.22% for the hazelnut class, highlighting the robustness of the proposed classification framework. In particular, the XGBoost model achieved F1-Scores of 95.43% for all classes and 97.64% for the hazelnut class on the test dataset using the 72-band dataset. When the 60 m resolution bands were excluded, F1-Scores of 94.88% for all classes and 97.90% for the hazelnut class were obtained. These findings indicate that although atmospherically sensitive bands may contribute to overall classification performance, more selective band combinations can provide better results for the target hazelnut class. Confusion matrix analyses revealed that misclassifications mainly occurred among spectrally similar classes, whereas hazelnut and forest classes were generally classified with high accuracy. Comparisons of the classified maps revealed that XGBoost and LightGBM produced highly similar class area estimates, whereas Random Forest generated more pronounced differences for certain classes such as grassland and forest. Furthermore, the 72-band dataset yielded slightly larger hazelnut area estimates than the reduced band combinations. Visual assessments indicated that differences among models and band combinations primarily occurred at the pixel level, particularly along class boundaries. Furthermore, visual analyses demonstrated that the 60 m resolution bands provided additional benefits, especially for the discrimination of water-related classes and the delineation of linear artificial surfaces. The decision-making mechanisms of the models were further investigated using SHAP analyses at both spectral band and phenological period levels. The results showed that the spectral bands and phenological periods contributing to model decisions varied depending on the selected model, target class, and dataset composition. The 60 m resolution Aerosol and Water Vapor bands provided by far the highest contribution in some models, while Red Edge and SWIR bands became more prominent after their removal. Phenological analyses revealed that Red Edge bands were particularly influential during the pre-leaf emergence periods, whereas the Red band reached its highest contribution levels during the fertilization stage in June. SWIR bands, on the other hand, became more influential during and after leaf emergence. Furthermore, the relative importance of phenological periods was found to vary depending on the target class. Although some variability was observed across different models, the fertilization period in June generally emerged as the most influential stage when all classes were considered together, whereas the female flower drop and leaf emergence period in March became more prominent in analyses focusing specifically on the hazelnut class. Local SHAP analyses were conducted using samples in which all pixels within a polygon were either completely correctly or completely incorrectly classified. The results indicated that models performed better in orchards with dense and homogeneous canopy structures, whereas higher confusion occurred between young and sparse orchards and the permanent cropland class. In addition, the spectral bands driving correct and incorrect predictions varied across target classes, indicating that different spectral characteristics contributed to model success and failure under different orchard conditions. To evaluate the influence of phenological periods on classification performance, Sentinel-2 images representing different phenological stages were analyzed individually using the XGBoost model. Lower performance values were obtained during the pre-leaf emergence and leaf emergence periods, whereas classification performance increased considerably during the fertilization and cluster development stages. The highest performance for all classes was achieved during the cluster development period (91.30% F1-Score), while the highest performance for the hazelnut class was obtained during the harvest period (96.13% F1-Score). Furthermore, datasets including the 60 m spatial resolution Aerosol and Water Vapor bands generally produced higher performance values. Based on the findings obtained from SHAP analyses, different band combinations were generated and evaluated. The results showed that high classification performance could be maintained using only the 20 most influential spectral bands. Notably, the band combinations derived from SHAP analyses considering all classes produced the highest performance values for both overall classification and the hazelnut class. The highest F1-Scores obtained from the band combination experiments were 97.22% for the hazelnut class and 94.55% for all classes. The deep learning-based segmentation study was conducted in a pilot area of approximately 110 km² characterized by intensive hazelnut cultivation using very high spatial resolution Pléiades Neo imagery. Within the scope of the study, the VHRHazelSeg dataset was developed using ground truth data generated through GEOBIA methods, and U-Net++, DeepLabv3+, and SegFormer segmentation architectures were evaluated using an SE-ResNeXt50 backbone. Experimental results demonstrated that all models achieved high segmentation performance, with the highest performance obtained by the U-Net++ model, which achieved 90.98% IoU and 94.97% F1-Score on the test dataset. U-Net++ and DeepLabv3+ produced highly similar results in both quantitative metrics and visual assessments, while SegFormer also achieved strong performance but remained slightly behind the CNN-based architectures. Confusion matrix analyses revealed that most misclassifications occurred among grassland, sparsely vegetated areas, and arable land classes. Nevertheless, more detailed parcel-level mapping and class discrimination could be achieved. These findings indicate that province-scale classification approaches based on Sentinel-2 imagery and deep learning-based segmentation studies conducted using very high spatial resolution imagery provide complementary information and can be effectively integrated for agricultural monitoring applications. In conclusion, this study demonstrated that remote sensing data acquired at different spatial and temporal resolutions can be effectively integrated for hazelnut area mapping and monitoring. The results highlighted the value of combining multi-temporal satellite observations with artificial intelligence techniques to capture both the phenological dynamics and spatial distribution of hazelnut cultivation areas. Furthermore, the use of explainable artificial intelligence approaches provided valuable insights into model behavior and feature importance, contributing to the development of more reliable and interpretable classification frameworks. Overall, the findings indicate that integrating machine learning, deep learning, and multi-scale remote sensing data offers significant potential for supporting precision agriculture applications, agricultural monitoring studies, and the development of agricultural information systems.
